Abstract
A jelfeldolgozásban felmerülő problémák megoldását hosszú időn keresztül a klasszikus harmonikus analízis módszerei, például a Fourier- és wavelet-transzformáció, határozták meg, amelyek segítségével a jelek egyszerűbb alkotóelemekre bonthatók, megkönnyítve ezáltal azok feldolgozását és elemzését. A mesterséges intelligencia (MI) térnyerésével azonban megnőtt az igény arra, hogy e transzformációkat korszerű mély neurális hálókkal ötvözzük. Ennek számos előnye van. Egyrészt a transzformációkon keresztül alkalmazásspecifikus (pl. mérnöki, fizikai vagy orvosi) ismeretek építhetők be az MI-modellekbe, ezáltal javítva azok általánosító képességét, megbízhatóságát és értelmezhetőségét. Másrészt e heurisztikák alkalmazásával a tanítás felgyorsítható (pl. a fizikailag irreleváns megoldások büntetésével), emellett csökkenthető a keresési tér dimenziója, a modellek számítási bonyolultsága, sőt akár a tanítóhalmaz mérete is. Ezt az ún. tudás-vezérelt MI tervezési paradigmát követve, ebben a kéziratban egy új, paraméterezett ortogonális transzformációkon alapuló keretrendszert mutatunk be, amely a szeparálható nemlineáris legkisebb négyzetes illesztések és a mély neurális hálók egységes integrációját teszi lehetővé. Ennek elméleti alapját a Hilbert-térbeli ortogonális projekciók differenciálhatóan paraméterezett kiterjesztése adja, amelyet racionális függvények és Hermite-féle ortogonális polinomok segítségével szemléltetünk. A javasolt adaptív projekciós módszer hatékonyságát EKG-jelek modellezésén, tömörítésén és osztályozásán keresztül igazoljuk. | For decades, signal processing has been largely dominated by classical harmonic analysis techniques, such as the Fourier and wavelet transforms, which decompose signals into simpler components to facilitate their analysis and processing. The rapid advancement of artificial intelligence (AI), however, has created a growing demand for integrating such transformations with modern deep neural networks. This fusion offers several important advantages. First, application-specific prior knowledge (e.g., from engineering, physics, or medicine) can be embedded into AI models through the underlying transforms, thereby improving their generalization capability, trustworthiness, and interpretability. Second, these domainspecific representations can constrain the learning process by penalizing physically implausible solutions, while simultaneously reducing the dimensionality of the optimization problem, the computational complexity of the resulting models, and even the amount of training data required. Motivated by the knowledge-augmented AI paradigm, this paper proposes a novel framework based on parameterized orthogonal transformations that unifies separable nonlinear least-squares optimization with deep neural networks. The proposed methodology is founded on a differentiable generalization of orthogonal projections in Hilbert spaces, enabling the projection operator itself to be learned jointly with the network parameters. The framework is realized using rational function systems and Hermite orthogonal polynomials as representative basis functions. The effectiveness of the resulting Variable Projections Networks (VPNet) is demonstrated on ECG signal modeling, data compression, and arrhythmia classification tasks, where the proposed adaptive projection framework provides an interpretable and computationally efficient alternative to conventional deep learning architectures.
